Safe Planning for Black-Box Systems via MAP Inference with Truncated Diffusion Priors and CBF-Informed Gibbs Likelihoods

arXiv:2610.41873v1 Announce Type: new Abstract: This paper proposes a maximum a posteriori (MAP) inference framework with a truncated diffusion prior for safe planning (TDP-SafeMAP). Under a generalized Bayesian formulation, a criterion based on covariance condition number determines the reverse diffusion truncation timestep, and the clean control distribution predicted at that timestep is approximated by a Gaussian prior encoding the control regularities and uncertainty of expert data. An energy function containing a control barrier function (CBF) constraint violation measure defines a Gibbs task likelihood that incorporates physical constraint information. After fusing the prior and likelihood, the covariance matrix adaptation evolution strategy (CMA-ES), whose core update admits an interpretation as a sampling-based approximation to natural-gradient ascent, approximates the posterior mode using only black-box evaluations. B\'ezier-curve-based dimensionality reduction and related techniques further improve computational efficiency and task-completion capability. Theoretical analysis establishes an error bound for the approximate MAP solution, an explicit condition for CBF safety preservation, and the equivalence of the MAP problem under prior whitening. Experimental results show that the proposed framework consistently generates safe, smooth, and goal-reaching trajectories, providing an effective and practical statistical inference approach to safe planning for black-box systems.
